Second of M2's stack (demo 1, rediscovering FlashAttention from causal attention in plain SQL), on #59's IR. This adds einfold_kernels::pipeline, which computes a Pipeline tile by tile so that its producer's results never exist in full. For attention, that means never holding the N² scores.

The algorithm (fused.rs).

  • Roles. Dimensions have four roles: X, the producer's kept outputs (queries i); E, summed by the producer (features); J, summed by the consumer (keys j); and Y, the values operand's own (value features d).
  • Placement. Keys are positions, as in the dense fold, and each operand is placed in a dense matrix, k transposed.
  • Tiles. For each tile of 64 X positions, on one thread, J is visited in tiles of 64, in order. Each pair computes its 64 × 64 block of producer values with a matrix product over E. It then scales them into scores and turns them into weights, folded into a scaled exponential accumulator (m, z, a[y]): the online softmax of Milakov and Gimelshein, rescaling z and a when a larger score raises the shift. With Shift::None the shift stays 0, as SQL's plain exp(s) does, overflow included.
  • Masks are absent rows. A condition between the one X and one J dimension allows an interval of J positions for each X position.
    • A pair of tiles it disallows entirely is never visited.
    • In a pair it disallows in part, disallowed pairs are skipped, not given weight 0: 0 · NaN is NaN, but SQL forms no row for them.
    • An X position left with no allowed J position has no output rows, as in SQL.
  • When it runs: every operand complete (one row, with a non-NULL factor, at every position) and keys small non-negative integers. Otherwise it returns None, so the operator (next PR) runs the host's plan. With complete inputs, both Normalizers agree.

Special values match SQL's arithmetic.

  • A NaN score makes its row NaN: the running maximum propagates NaN rather than skipping it, as f64::max would.
  • +∞ gives exp(∞ − ∞), which is NaN.
  • A row whose scores are all −∞ gives 0 / 0, NaN, as SQL's exp(−∞ − (−∞)) does.

Matrix products (gemm.rs) go through ndarray's safe interface to matrixmultiply, the library spike S27 used, which picks AVX2 and FMA kernels at run time. The workspace forbids unsafe, and matrixmultiply's own interface is unsafe. A hand-written safe micro-kernel was SSE2-bound: 70 ms at L = 4,096 against 36 with matrixmultiply. The cost of FMA: the bits are repeatable on one machine, but may differ between machines with and without it, as design §8.6 already notes for GEMM libraries.

Speed, causal attention with 64 features, from Arrow rows to Arrow rows on 12 threads:

L this PR S27's hand-written kernel
1,024 6.3 ms 3.4 ms
4,096 36 ms 27 ms
16,384 376 ms 330 ms

S27 measured DataFusion at 1.8 s for L = 1,024 and 53 s for L = 4,096, and out of memory by 8,192. The rest of the gap to S27 is placing the rows and building the output, which S27 also counted, plus exp. Comparing against the hosts on demo 1's SQL is the gate PR's job, once detection lands.

Invariants (tests/pipeline_vs_sql.rs), against DataFusion running the SQL the pipeline stands for. The cases cover:

  • random extents and masks (<, <=, >, >=, either way round, or none);
  • both shifts, three scales and both normalizers;
  • NaN, ±∞, values whose exp overflows, and rows whose scores are all −∞, or −∞ beside a NaN in the first tile only.
  1. With complete inputs, it runs. With a row missing, repeated or NULL, it declines, or gives SQL's result.
  2. The same rows as SQL: none for a query position the mask leaves no key.
  3. NaN and infinities exactly where SQL has them, and otherwise within 1e-9 · max|v|.
  4. The same bits for other batchings, orders and thread counts.

Five mutants were each caught: an off-by-one in the mask's interval; partly masked tiles multiplied whole (the 0 · NaN bug); no rescaling; a filled −∞ row given weight 1; and a running maximum that drops NaN. The last two needed the generated −∞/NaN rows above. A hand test checks that the causal mask leaves 136 of 256 tile pairs visited at L = 1,024. The GEMM's unit test checks the summation bound and repeatability.

Size. About 590 lines that aren't tests, over AGENTS.md's 400. fused.rs is one algorithm, and splitting off gemm.rs and the schema would still leave it at about 470.

After CodeRabbit's review

  • The fused algorithm declines a pipeline that sums one of its own dimensions away (an own dimension left out of the outputs). It writes a row per position of its own dimensions, so such a pipeline gave duplicate keys. declines_a_pipeline_that_sums_its_own_dimension_away pins it.

Walkthrough

The kernel adds a public fused pipeline API and output schema validation. It places operands into matrices and computes masked tiles with scaled accumulation. New tests compare results with DataFusion SQL and cover determinism, causal masks, unsupported inputs, and empty dimensions.

Merge Risk: Low · up to 887be

A rare empty-input shape can return incorrect rows or panic. Decline that shape, or explicitly accept the edge-case risk.

Security architecture risk: Low · up to 887be

The new execution path has a bounded availability risk: valid empty producer inputs can cause a panic instead of returning an empty result or declining execution. Exposure is currently limited to callers of the new library API; no production service integration is demonstrated.

Retained concerns

  • Medium · security · inferred: The fused eligibility boundary accepts an empty reduction domain that can escape the public Result/None contract. A valid plan with q(E), k(E,J), values v(J,Y), no X dimensions, and output Y accepts empty q/k alongside complete values. E then has runtime extent zero, but nx remains one. With at least 65 J positions, the second J tile slices the empty transposed-key matrix at offset 64 and panics before GEMM can return early. The worker panic propagates to the caller rather than permitting normal fallback. If an embedding application allows untrusted users to influence this plan and data, they can interrupt the library invocation; broader process or service impact depends on that application's panic containment. This path is newly introduced by the PR.
Security review details

Security Blast Radius

  • inferred — The demonstrated failure scope is an invocation of the new public Rust API and its worker threads. The facade does not catch panics. The inspected repository callers are tests; remote reachability, shared-service impact, and external consumers are not established.

Security Findings and Attack Paths

  • inferred — For the accepted zero-E-runtime-extent plan, only 65 complete J positions are needed to reach an out-of-bounds slice; large allocations or malformed schemas are unnecessary. With at most 64 J positions and Scale::One, the same eligibility gap instead produces a synthetic values average although the documented producer join has no groups. Both outcomes violate the result-or-decline boundary; denial-of-service exposure requires an embedding caller that accepts untrusted plan or data choices.

Trust Boundaries and Controls

  • observed — The library caller supplies the validated pipeline, relation batches, output schema, and thread options. The facade clamps thread count and delegates to fused validation. Matrix descriptors and multiplication remain crate-private, so this PR does not expose a raw matrix-memory interface.

Resilience and Maintainability Implications

  • inferred — The existing empty-query/key test is relevant counterevidence but covers a different shape: q holds an X dimension, whose zero extent prevents tile execution. It therefore does not establish failure containment when X has no dimensions and an E dimension has runtime extent zero. GEMM's zero-dimension guard also cannot protect a slice evaluated before the call.

Minor · Functional Correctness · Quick win

Decline when the E extent is zero. Otherwise empty inputs give one row where SQL gives none.

Take a producer whose first operand holds only E dimensions, so xs is empty. Make q and k empty, and give v rows. Then:

  • extent[e] is 0, because dense::keys returns extent 0 for an empty column.
  • nx is 1, because the product over an empty xs is 1.
  • ne is 0.
  • q has 0 rows and 1 × 0 cells, and k has 0 rows and 0 × nj cells, so place accepts both.

tile then multiplies over an empty E range. The k == 0 early return in gemm::multiply_add leaves every score at 0, so every weight is 1. The kernel emits one row, the plain average of v. SQL joins two empty relations, forms no producer group, and returns no rows. This changes the query's answer for the "empty groups" case.

When nx is above 0 and xs is not empty, ne == 0 cannot happen, because q would have no rows. Declining on ne == 0 therefore costs nothing else. The host then runs its own plan. The random generator in pipeline_vs_sql.rs always makes xs non-empty, so no test covers this shape.

🪭 Claude (einfold): No change needed: E's extent is zero only when neither q nor k has a row, and then X has no positions either, so no rows are emitted. That's what SQL's inner joins give. The new gives_no_rows_without_queries_or_keys runs an empty q and k beside a populated v, and checks that the result has no rows (or declines). It passes.

Replace the positional tuples with named-field structs.

tile takes its shape as an unnamed (usize, usize, usize, usize), and the call site builds it positionally at line 245. Because every member is usize, swapping two values still compiles and produces wrong shapes. The allowed closure returns an unnamed (usize, usize) interval, and spans repeats that pattern.

Use a Shape { x, e, j, y } struct for the dimensions. Use Range<usize> for each allowed interval. Range exposes named start and end fields and is half-open, which matches the existing lo < hi checks. The change touches the tile signature, the allowed closure, spans, and the body of tile, so this is a prose-only proposal rather than a single localized diff.

This follows the repository rule to prefer named-field structs to tuples. The **/*.rs path instruction and AGENTS.md both state it.

🪭 Claude (einfold): I've left this one. tile's extents and the half-open (lo, hi) spans are local to this file, and documented where they're built. The tile loop is the hottest code in the crate, and five pull requests above this one change it. Renaming its parameters here would turn each of their changes into a conflict, for no change in behavior. I'll take it up when the stack has merged.

A fold pipeline (attention's scores feeding a softmax-weighted average)
is computed tile by tile, so that the producer's results never exist
in full: for each tile of the kept output positions, on one thread,
the summed positions are visited in tiles, in order. Each pair of
tiles computes its block of producer values with a matrix product,
turns them into weights, and folds them into a scaled exponential
accumulator (the online softmax). A condition between the two
producer outputs, such as a causal mask, skips the pairs of tiles it
disallows entirely and skips, rather than zeroes, the pairs it
disallows in part. The algorithm runs when every input is complete
and NULL-free, and declines otherwise.

Third of M2's stack, on #69's fused algorithm. It runs a fold pipeline
inside DataFusion. Detection, which makes these nodes from demo 1's SQL,
is the next PR.

- **`PipelineNode`**, a logical node like `FoldNode`. Its inputs are the
producer's two operands, then the values operand. Its schema is
`pipeline_schema`'s, under the names the plan above uses. It always
keeps the plan it replaced: the fused algorithm has requirements
(complete, NULL-free inputs; keys small non-negative integers), and
there's no general algorithm for pipelines to fall back on, so the
host's plan is that.
- **`EinFoldExec` computes a fold or a pipeline**, as the design says
(§9.6, "`EinFoldExec` runs a pipeline node"). Rather than a second
operator, it holds either and shares everything around the kernel:
  - reading inputs, and counting them against the memory pool;
  - the host-plan fallback, including its reset for recursive queries;
  - running where there's no Tokio runtime;
  - slicing output to the session's batch size.

A pipeline needs a fallback, and its constructor is
`EinFoldExec::for_pipeline`. `fold()` now returns `Option<&Fold>`,
beside `pipeline()`.
- **`EXPLAIN`** shows the pipeline as its producer fold, then the
average, e.g. `a,b * c,b -> a,c where a >= c; softmax(/ 8, shifted) *
c,d -> a,d`.
- **`EXPLAIN ANALYZE`** counts `fused_pipelines`, and `tiles_visited` of
`tiles`: the pairs of tiles the mask let it skip, which is demo 1's
"about half the key tiles" criterion.
- `einfold_kernels::Algorithm` gains `Fused`.

**Tests** (`tests/pipeline_operator.rs`, hand tests of the wiring; the
algorithm's semantics are #69's property test). Causal attention as a
hand-built `PipelineNode` over DataFusion tables, `L = 150`, gives the
SQL's rows within `1e-12`:
- with complete inputs, the fused algorithm runs, visiting 6 of 9 pairs
of tiles;
- with a row of `v` missing, the host's plan runs.

## After CodeRabbit's review

- **A pipeline's fallback must match it column by column:** the same
types, and nullable only where the pipeline's column is.
- `PipelineNode`s that differ only in their column names no longer
compare as equal.
- A new operator test runs a pipeline with no values at all.

…es (#107)

🪭 Claude (einfold): This answers the review question on #59 and #69,
whether fold pipelines are general or specific to attention.

Fusing a pipeline needs only one condition: each producer group pairs a
consumer group with values of the dimensions the consumer sums away.
That holds for many queries besides attention, and since #101 the
producer can be any einsum or row expression. The consumer, though, was
fixed to a softmax: weights `exp(score)`, averaged. This PR makes it
general too.

**What changes**
- **The IR.** A pipeline's weight is now a `Weight`:
- `Weight::Exp { scale, shift }`, a softmax's `exp(score − shift)`, as
before;
- `Weight::Of(expression)`, any row expression of the producer's value.
Examples are a sigmoid `1 / (1 + exp(-s))` for sigmoid attention, a
Cauchy kernel `1 / (1 + d²)` of a squared distance, or `s` itself.

The sum is normalized, as before, or, with the new `Normalizer::None`,
not. A chain of two einsums, `SUM(scores.s * v.x)` over `scores = q ·
k`, is then a pipeline, fused without materializing the `N×M` scores.
- **The kernel.** A weight of an expression is evaluated over each row's
scores of a block, with the same evaluator as row expressions (#101),
and the row's state is plain sums. Only a softmax uses the scaled
accumulator. With no normalizer there's no division at the end, so a
shifted row whose every score is `-inf` is set to NaN outright, as SQL's
`exp(-inf - -inf)` makes it.
- **The detector.** It finds these weights in the forms it found
softmaxes in:
  - over a scores relation;
- merged by DataFusion into the scores' projection, such as `1 / (1 +
exp(-SUM(…) / 8))` directly over the aggregate, or the scores
themselves;
- on each pair of a `CROSS JOIN`, where any weight other than `exp`
becomes the pair's score itself.
- **Display.** `EXPLAIN` shows `weights(<expression>)` for such a
weight, and `unnormalized` for a sum without a normalizer.
- **Design.** Section 9.6 now says the consumer's weight is any row
expression, normalized or not.

**The tests check these invariants**
- **The IR**
(`a_weight_of_an_expression_reads_only_the_producers_value`): a weight
of an expression reads only the producer's value.
- **The kernel against SQL** (`pipeline_matches_sql`, 1,500 cases
locally) now draws:
  - a sigmoid or Cauchy weight, or the score itself;
  - any of the three normalizers;

together with the producers, masks and special values it drew before.
Unnormalized sums are compared within 1e-9 of each group's `Σ |w · v|`,
as SQL computes it; averages are compared as before. The `-inf` case
above was found by this test.
- **Detection** (`einfold_finds_pipelines_and_changes_no_answer`, 800
cases locally) adds three queries:
  - a sigmoid of attention's scores, averaged;
  - a Cauchy kernel of points over a `CROSS JOIN`, averaged;
  - `SUM(scores.s * v.x)`, the chain of einsums.

Each must be found, fuse on complete tables, and give DataFusion's rows
and values.

## After CodeRabbit's review

- **The fused algorithm declines where it can't match SQL's special
values,** so that the host's plan runs:
- where a larger score rescales a row whose sums of finite terms
overflowed to infinity (NaN where SQL gave 0, in normalized pipelines
too);
- where unnormalized or expression weights meet a weight or value that
isn't finite (#116 tracks fusing these exactly).

The property tests now expect a fused run only on complete, finite
inputs, and pass on 6,000 cases.

🪭 Claude (einfold): This answers the question on #69: "Isn't this
defined in previous PRs, e.g. the fuzzing PRs in 64 and 65?"

It was, and in more places than that. Seven test files each defined the
same small seeded generator:
- on `main`: `kernels_vs_sql.rs` and `detect_vs_host.rs`, and the fuzz
tests from #64 (`dense_metamorphic.rs`) and #65 (`simulation/rng.rs`);
- in this stack: `pipeline_vs_sql.rs`, `detect_pipelines.rs` and
`expression_vs_sql.rs`.

#65's original branch had a shared crate for it, `einfold-testkit`, but
the version that merged kept its own copy. This PR adds
`einfold-testkit` to the workspace, with #65's generator unchanged:
SplitMix64, as ddx's simulation tests use (ddx is an XQL Systems project
for automatic differentiation of SQL queries). It moves all seven tests
onto it. The crate has no dependencies, isn't published, and only
einfold's tests depend on it.

The PR sits at the top of the stack so that it can change every test
file at once.

Each test's random cases now come from new streams, so a seed from
before this change no longer replays the same case. Every test passes on
the new streams, at its default number of cases.

## After CodeRabbit's review

- The generator is pinned to SplitMix64's reference outputs for seed 0.
