Rebased onto upstream main at 16b81175874ecf11d5ff05c00de3b69e9457591b; current source: ff1ad6350050b3b11bec86364f5c1bfaecf23f78. All six commits in the rebased series include a Signed-off-by trailer.

Fresh single-B200 validation after rebuilding the extension: 701 passed, 0 failed, 30 skipped, plus 8 additional FP64 order 9–10 cases passed. Separate current-main layout checks: 33 passed, 0 skipped. Layout checks overlap the main suites and are not added to the main total. The hardware-specific skips remain separate from passes.

The earlier 0658d71 acceptance and its immutable figures/report remain historical evidence: 701 passed, 30 skipped, plus 8 additional FP64 cases. The results and figures below are regenerated from the rebased ff1ad63 source and its fresh extension.

The algorithm has no hard-coded derivative-order limit. Actual validation reaches order 8 for four precisions and nested JVPs, and order 10 additionally for FP64 reverse-mode directional/mixed derivatives. Performance against external implementations has not been measured for this expanded contract; prior first-order evidence is identified below.

What

  • Recursive autograd. Replace the Python chain of order-specific backward Functions with differentiable probability, fixed-order row reduction, row broadcast and target gather/scatter primitives. Their VJP/JVP rules use the same primitive set, allowing continued differentiation without adding a kernel for each new order.
  • Ordinary training fast path. Reuse the existing deterministic fused first-order CUDA backward when no derivative graph or transform is requested. Recursive and transform paths compose custom CUDA probability/row-sum kernels and ATen CUDA operations.
  • Transform support. Separate forward and setup_context, save inputs/outputs for reverse and forward AD, and provide JVP and explicit per-sample vmap rules. Cover grad, vjp, jvp, vmap, jacrev, jacfwd, hessian, nested transforms and JVP inside no_grad.
  • Precision and interfaces. Support FP32/FP16/BF16 and explicit FP64 across dense/indexed/out and online aliases. Explicit FP64 computes normalization and derivatives in double precision. Existing FP32/FP16/BF16 forward values and the default FP32 precision contract are preserved.
  • Indexed semantics. Keep full output row shape. Duplicate indices are idempotent, out-of-range indices are ignored, and invalid tokens/unselected rows have zero derivatives. Transform paths use a fixed-size selection mask.
  • out training. Copy differentiable results into the supplied buffer and retain storage identity. Reject initially grad-requiring buffers and input-storage aliases. Reuse after backward requires explicit detach. Transform-local buffers and independently mapped vmap buffers are supported; shared writes/captured external mutation are rejected. Training out may allocate temporary results.
  • Compatibility and docs. Preserve existing second-/third-backward extension symbols, while the Python derivative graph uses recursive primitives. Missing new bindings require rebuilding the extension. Update the B200 onboarding guide with the mechanism, buffer rules and tested range.
  • Current-main layout. Place native code and declarations in csrc/cuda/logprob and csrc/bindings/ops.cpp; Python implementations live in rl_engine/backends/cuda/logprob and regressions in tests/ops/logprob. Canonical and legacy import paths resolve to the same module and operator classes through the compatibility shims.
  • Migration audit. Verify that the deterministic operator class AST, recursive Python source bytes and native source bytes are preserved from 0658d71; also verify preserved generic/MUSA classes, legacy aliases, canonical/legacy module and class identity, and sign-off trailers. The final _C.pyi adjustment only reformats a declaration for Black; its AST is unchanged.

Prior art & reuse decision

The implementation builds on the repository's existing deterministic LogP rather than introducing a replacement forward algorithm.

Prior implementation Reused here / evidence Decision
Existing deterministic CUDA forward and indexed/out entry points, csrc/deterministic_logp_kernel.cu at baseline 87c9604 (now csrc/cuda/logprob/deterministic_logp_kernel.cu) Keep vocabulary buckets, reduction topology and the expression target_logit - row_max - log(row_sum); save LSE separately when AD needs it. 21 legacy binary comparisons match bitwise. Reuse as the forward source of truth.
Existing deterministic_logp_backward CUDA kernel Reused for ordinary first-order FP32/FP16/BF16 training; the explicit FP64 fused path from the earlier work is retained too. Profiler evidence checks the actual fused kernel. Keep the fused first-order fast path.
Earlier FP64/out/second-order work (20ad6a2) and third-order work (04bbecf) before rebasing Keep explicit FP64 arithmetic, buffer contracts, compatibility symbols and regression coverage. Remove order-specific Python dispatch and rejection nodes. Reuse the interfaces/contracts; replace the derivative-chain architecture.
PyTorch autograd / torch.func; log_softmax + target gather Reuse the AD/transform engine and standard CUDA tensor operations. Independently composed PyTorch expressions provide numerical references for derivatives and transforms. Use as infrastructure and oracle. The deployed probability evaluation and row reduction use custom CUDA primitives.

Existing-library candidates were also measured in my open LogP PR #495. That evidence concerns generic first-order selected-token LogP, with different source/environment/workload; it is not a rerun of this PR's full contract.

Candidate Prior evidence in #495 Evidence for replacing this PR's full path
Generic CUDA FusedLogpGenericOp / fused backward in #495 Batch-invariant first-order forward/backward and bounded workspace. Legacy deterministic forward bitwise compatibility, recursive AD, explicit FP64 and transform/out combinations were not audited there.
flash-attn Triton cross entropy, used by verl Passed that first-order batch-invariance audit and was faster than #495's CUDA kernel. This PR's full compatibility/transform contract has not been tested against it.
Liger cross entropy Passed that first-order batch-invariance audit with low workspace. This PR's full compatibility/transform contract has not been tested against it.
FLA fused cross entropy Failed 92/2232 forward and gradient batch-layout comparisons in that audit. No fresh full-contract audit here; that result is scoped to #495's pinned version/workload.
vLLM batch-invariant log_softmax Forward-only in the audit reported by #495. No backward/high-order/transform validation in that audit.

Decision: reuse the existing deterministic CUDA forward and fused first-order backward, and PyTorch's AD infrastructure; add only the recursive primitives and transform rules needed by the expanded contract. External cross-entropy implementations remain reuse candidates, but their prior first-order results do not establish old-forward bitwise compatibility or the new FP64/indexed/out/transform contract. This PR does not claim comparative speed/memory superiority or that those candidates cannot support higher derivatives; external full-contract qualification remains unmeasured.

Results (B200)

Environment: 1 × NVIDIA B200 (SM100), PyTorch 2.9.1+cu130, CUDA 13.0, source ff1ad6350050b3b11bec86364f5c1bfaecf23f78, based on upstream main at 16b81175874ecf11d5ff05c00de3b69e9457591b.

The native extension was rebuilt for the canonical source layout before rerunning acceptance. The final Black-only _C.pyi formatting adjustment preserves its AST and does not change native sources.

Extension SHA-256: 9f87d7a020445934907617eb61c9009e07434c0e5a33b67fd4cdca8edbc3ff8e.

Acceptance results

Check Result
Legacy forward binary comparisons 21/21 bitwise equal
Profiler cases: fused first-order, recursive and torch.func paths 48/48 passed
Three-step SGD and Linear parameter updates passed
Strict deterministic GRPO 3 steps passed; train_logp_source=DeterministicLogpCUDAOp
FP64 gradcheck, gradgradcheck and finite-difference JVP passed
Layout determinism: repeat, chunk, reorder and padding passed in the recorded cases
Strict documentation build passed
Canonical/legacy identity and source-preservation migration audit passed

Profiler evidence records deterministic_logp_backward_kernel, deterministic_logp_probability_kernel, deterministic_logp_row_sum_kernel and the actual forward kernels, with ATen operations listed separately. Recursive derivatives are a composed graph, not a single fused kernel.

Derivative error by order

Points are maximum absolute error by precision/order/method against independent PyTorch references. All recorded cases meet their individual tolerances. Exact-zero values are annotated and omitted from logarithmic axes. Dashed lines show order 4+ tolerances; order 1–3 case-specific tolerances and errors are in the CSV. Bounded inputs/directions are used, so this plot does not predict error for larger models or untested orders.

Algorithm and tested range

The algorithm has no programmed order cap: derivative rules are closed over the same primitives. Higher orders can require larger graphs, more intermediate storage and more runtime; rounding, cancellation and underflow can affect accuracy. Those workload-dependent costs do not impose a fixed algorithmic order limit.

  • Four precisions: reverse-mode directional/mixed derivatives and nested JVPs at orders 1–8.
  • FP64: additional reverse-mode directional/mixed derivative checks at orders 9–10.
  • Forward-mode validation stops at order 8. Gray cells and orders beyond the matrix are untested. Finite validation is not a proof for every derivative order.

Evidence directory: full report, per-case CSV, PNG/SVG figures, figure-generation script and SHA-256 manifest. The report records source/extension identity, numerical errors, actual backends and individual pass/fail/skip reasons.

Re-run with the shared torch 2.13.0+cu130 environment at head ff1ad635 (B200). test_deterministic_logp_recursive.py 89 passed; order 9 to 10 FP64 cases 8 passed; tests/ops/logprob 588 passed, 53 skipped (SM90 / Ascend / two-GPU); layout test 16 passed; the backend probe verified 48 traces. So the recursive and nested-JVP paths also pass on torch 2.13, not only on 2.9.1. The full run-validation.sh acceptance was not rerun. Raw data: {link(547)}.

Tests

Suite Passed Skipped
Existing LogP/autograd/onboarding regressions 222 30
FP64/out/second-order regressions 138 0
Third-order regressions, updated for recursive AD 117 0
Recursive derivatives and transform regressions 89 0
Supplemental acceptance 135 0
Main total 701 30
Additional FP64 order 9–10 acceptance 8 0
Separate current-main layout CI (overlaps main suites) 33 0

The skips are exactly 15 SM90/Hopper-only + 15 Ascend-only cases. Neither applies to B200; neither is counted as passed.

New derivative/transform coverage includes vmap(grad), vmap(jvp), nested vmap, forward-over-reverse, reverse-over-forward, forward-over-forward, reverse-over-reverse, direct forward-AD dual tensors and no_grad JVP. Edge cases include noncontiguous/empty inputs, invalid labels, empty/duplicate/out-of-range indices, storage identity, preserved unselected out values and detached buffer reuse.

From the implementation checkout, with a matching CUDA extension:

TORCH_CUDA_ARCH_LIST=10.0 python setup.py build_ext --inplace
python -m pytest -q -rs tests/ops/logprob/test_deterministic_logp_recursive.py
RL_KERNEL_LOGP_MAX_ORDER=10 python -m pytest -q -rs \
    tests/ops/logprob/test_deterministic_logp_recursive.py -k 'recursive_orders and dtype3'
python tools/validation/operators/probe_deterministic_logp_autograd.py --output recursive-backends.json

Full rebased-source acceptance from the validation workspace:

bash runs/b200-autograd/final-main-validation/run-validation.sh

The full runner repeats legacy forward comparisons, training integration, canonical-layout checks and strict documentation checks, recording individual commands and outcomes. It verifies that the original 0658d71 evidence remains unchanged. The new asset directory contains the rebased-source report, per-case data, logs and figure-reproduction files; the live GPU execution environment and old binary baseline remain in the original validation workspace. All active figures and results refer to the rebased source and fresh extension identified above.

Scope / Known limitations

  • Hardware: single B200. SM90, Ascend, ROCm and multi-GPU execution are not validated by this acceptance.
  • Numerics: original default FP32 contracts are preserved; FP64 training/AD uses explicit FP64 interfaces. Actual tested derivative orders are listed above.
  • Transform batching: initial vmap rules execute explicit per-sample work; no vectorized batching speedup is claimed.
  • Buffers: out training permits temporary allocations; shared mutation and grad-requiring/aliased buffers are rejected.
  • Compatibility: requires rebuilt native bindings. Nested JVP handling uses PyTorch internal forward-AD hooks and is validated in the recorded PyTorch 2.9.1 environment; other versions need matching validation.
  • Performance and integration: no comparative latency/memory benchmark, torch.compile/functionalize acceptance or production-model training guarantee.

Relation to other work

This work advances the NVIDIA/B200 portion of #23; it does not close AMD onboarding. #495 targets generic fused LogP first-order workspace/performance, while this work targets deterministic LogP's existing forward contract and recursive AD/transforms. This PR is rebased onto current main; future changes to LogP/native bindings still need checking against the shared-file changes.

Walkthrough

The change extends deterministic CUDA LogP with saved LSE, FP64 operations, and higher-order autograd support. It adds Python dispatch and output-buffer handling, CUDA tests and a kernel probe, and B200 onboarding guidance. Separate updates adjust usage-document links and an NPU dispatch test.

Changes: Deterministic LogP and B200 Onboarding

Layer / File(s) Summary
FP32 forward with saved LSE
csrc/deterministic_logp_kernel.cu
The FP32 forward path can return row LSE. The indexed output entry point now checks logits alignment locally.

Merge Risk: Low · up to 0658d

The deterministic LogP autograd changes appear sound for the validated B200 workflows. Two exported closed-form derivative bindings have no callers or tests and should be removed or tested as a follow-up. This does not block merging.

Security Architecture Review

Security architecture risk: 🔵 Low · up to 0658d

The expanded interfaces retain tensor validation and add protections for gradient-aware output buffers. No introduced security vulnerability was established in the reviewed paths. Confidence remains limited for concurrent buffer reuse, interrupted GPU operations, and configurations beyond the recorded single-GPU validation.

Retained concerns
No architecture-level concerns identified.

Security review details

Security Blast Radius

  • inferred — The traced exposure is through local Python calls and native-extension bindings acting on caller-provided tensors. The reviewed failure scope centers on the calling process's tensor state and CUDA workload; no remote or cross-tenant attack path was established by this evidence.

Trust Boundaries and Controls

  • observed — The indexed-forward alignment check moved from the shared index checker into the existing indexed-out entrypoint rather than disappearing from that path. Packed backward loads and stores independently check pointer alignment and fall back to scalar access; tail accesses are bounded. The reviewed alignment change does not establish an unsafe-access bypass.

Resilience and Maintainability Implications

  • observed — Direct non-AD output-buffer writes existed at the base and remain available at the head. New gradient-aware paths add validation and compute-before-copy containment; they do not introduce a demonstrated transactional guarantee. Concurrent reuse and recovery after interrupted GPU writes remain unproven, not observed PR vulnerabilities.

Hardening Proposals

  • proposed — Document exclusive ownership requirements for caller-supplied output buffers and distinguish compute-before-copy behavior from transactional recovery after CUDA faults or concurrent mutation.

Remove or test the unused closed-form backward bindings.

The recursive autograd implementation uses _Probability, _Sum, _Expand, _Gather, and _Scatter. No in-repository caller invokes deterministic_logp_double_backward or deterministic_logp_triple_backward.

If these bindings are not an intended public fast path, remove their CUDA implementations, registrations, and _C.pyi declarations. If they are retained, add direct tests against the recursive implementation.
