Part 3 of #251, stacked on the window rewrite. It holds the max-shift of a softmax or log-sum-exp constant, since its gradient is zero.

Why

A softmax subtracts each group's max m before exp, so that exp can't overflow: exp(x − m) / SUM(exp(x − m)). A log-sum-exp is written m + ln(SUM(exp(x − m))). Neither result depends on m: raise m by δ, and every term and their sum scale by e^−δ. So the ratio is unchanged, and ln of the sum falls by exactly as much as m rises.

ddx computed m̄ anyway. It took a sum over every row of every group and gave zero, up to rounding (#243's first finding).

How

The new module shift.rs finds each saved value m whose every use is one that cancels. Here, a group "holds m" when it holds m's dims equal to its own keys. The accepted uses:

  • x − m, and exp of it;
  • the SUM of those terms over a group that holds m, which is a normalizer;
  • MAX, MIN or AVG of m over such a group;
  • ln of a normalizer;
  • a term divided by its own group's normalizer;
  • m plus its group's log-normalizer.

Any other use leaves m varied: m in the output, in a grouping key, in a window or in a subquery. Forward reads the plan once to find these values, then reads it again with them held constant, as jax.nn.softmax holds its max with stop_gradient.

The equalities a region holds, which #253 added for the normalizer rule, move to equal.rs, so that both rules can use them.

Results

before after
GPT step 82–83 ms 72–73 ms
ad_perf nn, 4,096 samples 267 ms 188 ms
ad_perf attention, L=256 321 ms 273 ms

Causal attention's backward is now 11 steps in both spellings, and only one of them, dS, has a row per score. With #253, that's every score-sized table short of recomputing.

Tests

  • a_shift_that_cancels_matches_its_gradient: 60 random cases for each form, the softmax and the GPT's MAX(m) + ln(SUM(exp(val - m))) over a windowed m. Each is compared with the same query written so ddx can't recognize m (times exp(m − m)). It also checks that no backward step transposes a MAX once m is held.
  • attentions_backward_writes_one_table_of_scores: checks both spellings.
  • a_max_used_beyond_its_softmax_keeps_its_gradient: finite differences, for a loss that also reads m.
  • perf(ddx-ad): a normalizer's cotangent from the saved output, not a sum over the region #253's structural test is replaced by the score-counting test, which is stronger. With m held, the normalizer's cotangent has one reader, so it's folded into that reader and has no step of its own to inspect.
  • The full suite passes.

Next

The last part of #251: recomputing the scores instead of saving them, as an option.

Walkthrough

The PR adds analysis that identifies saved outputs whose shifts cancel and holds those outputs during forward reads. It moves equality helpers into a shared module and adds tests for attention plans and gradient agreement.

Changes: Shift Cancellation in Differentiation

Valid plans containing emitted joins or filters can now panic during differentiation setup. Guard both relation types before merging. Restoring the normalizer dependency assertion would also strengthen performance regression coverage.

Repeated per-candidate walk adds plan-construction work.

cancelling calls cancels once for each candidate. Each cancels call visits every later saved region and then the output. A region that reads no tainted aggregate returns early from kinds, but cancels still classifies that region's groupings and measure arguments. The same plan metadata is therefore scanned once per candidate, so construction work grows with the number of candidates multiplied by the number of later regions.

Any shortcut that skips later regions must keep those grouping and measure checks. Skipping them would stop rejecting unsupported grouping expressions, which kind maps to Kind::Bad when fields_of fails. It would also stop propagating function-lookup errors from ScalarFunction nodes.

Check which tables each backward step reads, not only row counts.

attentions_backward_writes_one_table_of_scores (attention.rs:177-206) counts only backward steps with more than eight rows. It then asserts that exactly one such step exists. A regression that makes the normalizer cotangent read both q and k can emit eight or fewer rows. That regression passes this test.

The removed the_normalizers_cotangent_reads_no_score test at the merge base checked the tables each backward step reads. It caught this case. Add an assertion that walks the backward steps from the normalizer's cotangent and fails when one step reads both score inputs. Use the table reads of each step, not a row count.

…gradient is zero

A softmax subtracts each group's max m before exp so it can't overflow,
`exp(x − m) / SUM(exp(x − m))`, and a log-sum-exp is written
`m + ln(SUM(exp(x − m)))`. Neither depends on m: raise it by δ and each
term and their sum scale by e^−δ, so the ratio stays, and ln of the sum
falls by δ as m rises by it. ddx computed m̄ anyway, with a sum over
every row of every group that gives zero up to rounding (#243, #251).

`crate::shift` finds each saved value m whose every use is one that
cancels: `x − m`, `exp` of it, its `SUM` over a group that holds m's
dims equal to its keys (a normalizer), MAX, MIN or AVG of m over such a
group, `ln` of a normalizer, a term divided by its own group's
normalizer, and m plus its group's log-normalizer. Anything else, such
as m in the output, a grouping key, a window or a subquery, leaves m
varied. Forward reads the plan once to find these, then again with
them held constant, as jax.nn.softmax holds its max with
stop_gradient.

The equalities a region holds, used by the normalizer rule, move to
`crate::equal` so both rules share them. With the normalizer rule,
attention's backward writes one table with a row per score (dS), in
both spellings. The normalizer's cotangent no longer has a step of its
own (it's inlined into its one reader), so its test is replaced by
one that counts score-sized steps.
